The Implementation and Evaluation of Learning Approaches to State Filtering

Abstract [en]

State estimation uses measurements of a system’s output to estimate the state. A particular method within state estimation is filtering, which estimates the state using measurements up to and including the current time. Common filters are the Kalman filter, the Extended Kalman filter and the Particle filter for unconstrained linear and nonlinear systems respectively. Moving Horizon Estimation is an alternative filter that accounts for state constraints; however, these filters are reliant on an accurate system model. Thus, when the model is uncertain, an alternative strategy is to develop a filter that, using neural networks, learns the filtering task from data. Such black-box filters has been implemented but needs further evaluation. A black-box filter requires much data for training and it does not consider constraints. Therefore, this thesis implements and evaluates two state filters: a DNN filter that is completely based on a neural network and the MHENet that incorporates a neural network into the filtering pipeline and considers constrains imposed on the state. The DNN f ilter has been implemented and evaluated for one-dimensional linear and nonlinear systems. The MHENet is evaluated for linear one- and two-dimensional systems. The tests show that Kalman filter and the Particle filter outperform the DNN filter in terms of tolerance to model uncertainty. Also, the DNN filter experiences difficulties during training when the states to be estimated diverges. The MHENet is shown to outperform the Kalman filter when the model is uncertain and when constraints are imposed on the state. Lastly, the MHENet is shown to perform better than the DNN filter for linear one-dimensional system showing the benefits of including structural knowledge in the filter setup.

Abstract [sv]

Ett systems tillstånd skattas genom att exempelvis filtrera mätningar av systemets utsignal. De vanligaste filtren för obegränsade linjära och olinjära system är Kalmanfiltret, Extended Kalmanfiltret och partikelfiltret. Moving Horizon Estimation är en annan typ av filter som kan skatta tillståndet av system med begränsningar på tillståndet. Gemensamt för de filter som presenterats är att de är baserade på en noggrann modell av ett system och därför behövs alternativa metoder då en modell inte kan bestämmas med säkerhet. En sådan metod är att träna ett neuralt nätverk med hjälp av data för att lära sig tillståndsskattningen. Det finns implementationer av sådana filter men dessa behöver utvärderas ytterligare, vidare är en nackdel med sådana filter är att de behöver en stor mängd data för att tränas och de tar inte hänsyn till eventuella begränsningar på tillståndet. I denna masteruppsats implementeras och utvärderas därför två olika filter: ett DNN filter som helt är baserat på ett neuralt nätverk och MHENet som delvis använder sig av ett neuralt nätverk och samtidigt tar hänsyn till begräsningar på tillståndet. DNN filtret har implementerats för linjära och olinjära system i en dimension och MHENet har implementerats för linjära system i en respektive två dimensioner. Numeriska tester visar att DNN filtret är mer känsligt för osäkerhet i modellen än både Kalmanfiltret och partikelfiltret. DNN filtret påvisar också inlärningssvårigheter när tillståndet som ska skattas divergerar. MHENet presterar likvärdigt Kalmanfiltret och bättre i de fallen då modellen är osäker eller då begräsningar på tillståndet finns. Slutligen visar testerna att MHENet presenterar bättre än DNN filtret för linjära system i en dimension vilket påvisar fördelarna att integrera ett neuralt nätverk i filtreringsprocessen.
